1Multivariate Density Estimation Via Adaptive Partitioning (II): Posterior Concentration

In this paper, we study a class of non-parametric density estimators under Bayesian settings. The estimators are piecewise constant functions on binary partitions. We analyze the concentration rate of the posterior distribution under a suitable prior, and demonstrate that the rate does not directly depend on the dimension of the problem. This paper can be viewed as an extension of a parallel work where the convergence rate of a related sieve MLE was established. Compared to the sieve MLE, the main advantage of the Bayesian method is that it can adapt to the unknown complexity of the true density function, thus achieving the optimal convergence rate without artificial conditions on the density.

In this paper, we consider the nonparametric estimation of the multivariate probability density function and its partial derivative with a support on $[0,\infty)$. To this end we use the class of kernel estimators with asymmetric gamma kernel functions. The gamma kernels are nonnegative. They change their shape depending on the position on the semi-axis and are robust to the boundary bias problem. We investigate the mean integrated squared error (MISE) assuming dependent data with strong mixing and find the optimal bandwidth of the kernel as a minimum of the MISE. We derive the bias, the variance and the covariance of the density and of its partial derivative.

3Multivariate Nonparametric Volatility Density Estimation

We consider a continuous-time stochastic volatility model. The model contains a stationary volatility process, the multivariate density of the finite dimensional distributions of which we aim to estimate. We assume that we observe the process at discrete instants in time. The sampling times will be equidistant with vanishing distance. A multivariate Fourier-type deconvolution kernel density estimator based on the logarithm of the squared processes is proposed to estimate the multivariate volatility density. 4FFT-Based Fast Bandwidth Selector For Multivariate Kernel Density Estimation

The performance of multivariate kernel density estimation (KDE) depends strongly on the choice of bandwidth matrix. The high computational cost required for its estimation provides a big motivation to develop fast and accurate methods. One of such methods is based on the Fast Fourier Transform. However, the currently available implementation works very well only for the univariate KDE and it's multivariate extension suffers from a very serious limitation as it can accurately operate only with diagonal bandwidth matrices. A more general solution is presented where the above mentioned limitation is relaxed. Moreover, the presented solution can by easily adopted also for the task of efficient computation of integrated density derivative functionals involving an arbitrary derivative order. Consequently, bandwidth selection for kernel density derivative estimation is also supported. The practical usability of the new solution is demonstrated by comprehensive numerical simulations.

The paper deals with the density estimation on Rd under sup- norm loss. We provide with fully data-driven estimation procedure and establish for it so called sup-norm oracle inequality. The pro- posed estimator allows to take into account not only approximation properties of the underlying density but eventual independence struc- ture as well. Our results contain, as a particular case, the complete solution of the bandwidth selection problem in multivariate density model. Usefulness of the developed approach is illustrated by appli- cation to adaptive estimation over anisotropic Nikolskii classes.

8Adaptive Bayesian Multivariate Density Estimation With Dirichlet Mixtures

We show that rate-adaptive multivariate density estimation can be performed using Bayesian methods based on Dirichlet mixtures of normal kernels with a prior distribution on the kernel's covariance matrix parameter. We derive sufficient conditions on the prior specification that guarantee convergence to a true density at a rate that is optimal minimax for the smoothness class to which the true density belongs. No prior knowledge of smoothness is assumed. The sufficient conditions are shown to hold for the Dirichlet location mixture of normals prior with a Gaussian base measure and an inverse-Wishart prior on the covariance matrix parameter. Locally H\"older smoothness classes and their anisotropic extensions are considered. Our study involves several technical novelties, including sharp approximation of finitely differentiable multivariate densities by normal mixtures and a new sieve on the space of such densities.

9The Stochastic Approximation Method For The Estimation Of A Multivariate Probability Density

We apply the stochastic approximation method to construct a large class of recursive kernel estimators of a probability density, including the one introduced by Hall and Patil (1994). We study the properties of these estimators and compare them with Rosenblatt's nonrecursive estimator. It turns out that, for pointwise estimation, it is preferable to use the nonrecursive Rosenblatt's kernel estimator rather than any recursive estimator. A contrario, for estimation by confidence intervals, it is better to use a recursive estimator rather than Rosenblatt's estimator.

10Pointwise Adaptive Estimation Of A Multivariate Density Under Independence Hypothesis

In this paper, we study the problem of pointwise estimation of a multivariate density. We provide a data-driven selection rule from the family of kernel estimators and derive for it a pointwise oracle inequality. Using the latter bound, we show that the proposed estimator is minimax and minimax adaptive over the scale of anisotropic Nikolskii classes. It is important to emphasize that our estimation method adjusts automatically to eventual independence structure of the underlying density. This, in its turn, allows to reduce significantly the influence of the dimension on the accuracy of estimation (curse of dimensionality). The main technical tools used in our considerations are pointwise uniform bounds of empirical processes developed recently in Lepski [Math. Methods Statist. 22 (2013) 83-99].

11Flexible Multivariate Density Estimation With Marginal Adaptation

Our article addresses the problem of flexibly estimating a multivariate density while also attempting to estimate its marginals correctly. We do so by proposing two new estimators that try to capture the best features of mixture of normals and copula estimators while avoiding some of their weaknesses. The first estimator we propose is a mixture of normals copula model that is a flexible alternative to parametric copula models such as the normal and t copula. The second is a marginally adapted mixture of normals estimator that improves on the standard mixture of normals by using information contained in univariate estimates of the marginal densities. We show empirically that copula based approaches can behave much better or much worse than estimators based on mixture of normals depending on the properties of the data. We provide fast and reliable implementations of the estimators and illustrate the methodology on simulated and real data.

12Bayesian Multivariate Mixed-scale Density Estimation

Although univariate continuous density estimation has received abundant attention in the Bayesian nonparametrics literature, there is limited theory on multivariate mixed scale density estimation. In this article, we consider a general framework to jointly model continuous, count and categorical variables under a nonparametric prior, which is induced through rounding latent variables having an unknown density with respect to Lebesgue measure. For the proposed class of priors, we provide sufficient conditions for large support, strong consistency and rates of posterior contraction. These conditions allow one to convert sufficient conditions obtained in the setting of multivariate continuous density estimation to the mixed scale case.

The approach follows state-of-the-art work on online density estimation, but was redesigned with computational efficiency, numerical robustness, and extensibility in mind. Our approach produces comparable or better results than the current state-of-the-art, while achieving significant computational performance gains and improved numerical stability. The use of diagonal covariance Gaussian kernels, which further improve performance and stability, at a small loss of modelling quality, is also explored. Our approach is up to 40 times faster, while requiring 90\% less memory than the closest state-of-the-art counterpart.

15Multivariate Density Estimation Via Adaptive Partitioning (I): Sieve MLE

We study a non-parametric approach to multivariate density estimation. The estimators are piecewise constant density functions supported by binary partitions. The partition of the sample space is learned by maximizing the likelihood of the corresponding histogram on that partition. We analyze the convergence rate of the sieve maximum likelihood estimator, and reach a conclusion that for a relatively rich class of density functions the rate does not directly depend on the dimension. This suggests that, under certain conditions, this method is immune to the curse of dimensionality, in the sense that it is possible to get close to the parametric rate even in high dimensions. We also apply this method to several special cases, and calculate the explicit convergence rates respectively.

We consider the problem of estimating the population probability distribution given a finite set of multivariate samples, using the maximum entropy approach. In strict keeping with Jaynes' original definition, our precise formulation of the problem considers contributions only from the smoothness of the estimated distribution (as measured by its entropy) and the loss functional associated with its goodness-of-fit to the sample data, and in particular does not make use of any additional constraints that cannot be justified from the sample data alone. By mapping the general multivariate problem to a tractable univariate one, we are able to write down exact expressions for the goodness-of-fit of an arbitrary multivariate distribution to any given set of samples using both the traditional likelihood-based approach and a rigorous information-theoretic approach, thus solving a long-standing problem. As a corollary we also give an exact solution to the `forward problem' of determining the expected distributions of samples taken from a population with known probability distribution.

Continuous multivariate data is ubiquitous in U.S. Military Operations Research. Since continuous distributions are fully characterized by their probability density functions, we concentrate on estimating such functions. Current estimation methods perform well for low dimensions; however, they can be too restrictive to capture the actual data characteristics, and can become intractable beyond three dimensions. This work develops a new estimation technique that seeks to increase flexibility and mitigate the curse of dimensionality. We achieve both by modeling the actual density using piecewise affine functions; however, we impose a nonconvex maximum likelihood optimization problem. The problem includes nine parameters, which can each affect the resulting estimate likelihood value and computation time. We conduct case studies on estimating the density for data up to five dimensions on sample sizes as low as 100 points. The results indicate progress in moderating the nonconvexity challenge to optimize the likelihood, and demonstrate potential advantages over currently used methods.

In a number of situations, the experimenter is confronted with the statistical analysis of the data which is binary in nature. For example, one may be interested in diagnosis of the disease on the basis of symptoms. The reliability of complicated systems can be studied by examining as to whether its components are functioning or not. In image processing, a picture is classified on the basis of two grey levels like white and black using some threshold value. We may assign a score of 1 or 0 according as the grey level is white or black respectively. So, it is important to study the problems of estimation of multivariate binary density. Cencov expressed continuous multivariate density as a series of orthonormal functions. Bahadur expressed the multivariate binary density as a series. Ott and Kronmal expressed the density as a series involving Walsh functions. Liang and Krishnaiah also expressed the density in terms of Walsh functions but the coefficients in their series are different from those used by Ott and Kronmal. This paper is a continuation of the work done by Liang and Krishnaiah.

The problem addressed concerns the estimation of a p-dimensional multivariate density, given only a set of n observation vectors, together with information that the density function is likely to be reasonably smooth. A solution is proposed which employs up to n + 1/2 p(p+1) smoothing parameters, all of which may be estimated by their posterior means. This avoids the well-known difficulties, associated with even one-dimensional kernel estimators, of estimating the bandwidth or smoothing parameter by a mathematical procedure. The posterior mean value function, unconditional upon the smoothing parameters, turns out to be a data-based mixture of multivariate t-distributions. The corresponding estimate of the sampling covariance matrix may be viewed as a shrinkage estimator of the Bayes-Stein type. The results involve some finite series which may be evaluated by straightforward simulation procedure. (Author)

A sub-prior investigates this story and finds that the Bible is now back in the owner's hands. Later, Elspeth's son sees the White Lady when he snatches the Bible from a flaming altar. Intrigue follows intrigue. Halbert and Sir Piercie Shafton fight, and Halbert flees, leaving Sir Piercie mortally wounded. Shafton, however, recovers only to be accused of murdering Edward's missing brother. Mysie helps Shafton escape from jail. Edward has vowed to become a monk at the urging of the White Lady. After a battle between English and Scottish soldiers against Sir John's troops, Mysie is declared a suitable wife for Sir Piercie. The monks are allowed to keep their monastery. Captain Scott’s ill-fated journey to the Antarctic Pole in 1911 is part triumph, part tragedy – but also a mythic adventure story which has inspired books, articles, and films over the generations. As so often in such cases the ‘truth’ of the explorers’ experiences (and there were many important figures in the party besides Scott) is much more rich, varied, and fascinating than the boy scout stereotype. Few know for example how much time during the many months of the journey were spent in scientific researches which remain of huge value to this day. But what comes across most vividly in Scott’s fascinating and finally very moving diary account is the complexity of the man and his closest comrades who reached the Pole fatally too late (the Norwegian Amundsen has beaten them to it by many weeks), then died trekking home, facing tortuous weather conditions, dwindling food supplies, and that gnawing, bitter sense of defeat. Ironically Robert Falcon Scott is now far more famous than Amundsen: his triumph secured by history and by myth. For if Scott was finally an imperfect explorer, he was the perfect author of his own amazing tale. Scott’s account is introduced by Clements R. Markham, president of the Royal Geographical Society at the time of the expedition; and concluded by E.L.
